Smart Traffic Violation Detection Using Faster R-CNN Algorithm

Abstract – Urban traffic violationssuch as signal jumping, helmetless riding, and incorrect lane usagepose significant threats to road safety and often go unnoticed due to limitations in manual surveillance. This paper introduces a smart, automated system based on Faster R-CNN to address this issue. By analyzing real-time video streams from traffic cameras, the model identifies rule violations and captures vehicle number plates using Tesseract OCR. The system then generates e- challans and sends alerts to the violators digitally, eliminating the need for manual monitoring. This approach improves enforcement transparency, reduces human error, and offers a scalable solution for modern traffic regulation in smart cities

INTRODUCTION:
Urban traffic systems today face significant pressure due to the continuous rise in vehicle numbers and the complexity of managing rule enforcement manually. Conventional traffic policing struggles to monitor every vehicle and catch violators in real time, especially in congested city environments. Violations such as jumping red signals, driving in the wrong lane, or riding without helmets or seat belts often go unnoticed, contributing to accidents, gridlocks, and unsafe roads.
Furthermore, relying solely on manual enforcement can lead to challenges like insufficient evidence, missed violations, and at times, unfair penalty issuance due to human error or bias. These limitations highlight the need for intelligent systems that can aid traffic authorities in monitoring roads with greater efficiency.
With advancements in Artificial Intelligence (AI) and Computer Vision (CV), it is now feasible to design systems capable of automatically identifying traffic rule violations. By integrating surveillance camera feeds with deep learning models, such systems can process video in real time to detect non-compliance with traffic laws. This project presents a solution using the Faster R-CNN model, which identifies key violations and, through Optical Character Recognition (OCR), reads vehicle number plates to initiate automated alerts or fines. The goal is to reduce manual involvement, enforce rules more consistently, and create safer road conditions.

Enable real-time traffic violation detection by analyzing live footage from surveillance cameras installed at intersections, highways, and other critical road locations.

Employ the Faster R-CNN deep learning framework for accurately recognizing objects such as vehicles, traffic signals, helmets, and lane boundaries to detect violations.

Integrate Optical Character Recognition (OCR) using Tesseract to extract vehicle registration numbers from footage for identification, even under varying image quality.

Automate the process of issuing penalties, such as generating and dispatching digital challans or alert messages to registered vehicle owners without human intervention.

The system begins by collecting video input from CCTV or surveillance cameras placed at traffic-heavy locations such as signals, junctions, and highways. These video feeds serve as the primary source for detecting rule violations, including red-light jumping, lane misuse, helmetless riding, and seatbelt non-compliance.

Violation Detection Using Faster R- CNN
A pre-trained Faster R-CNN model, fine- tuned on a custom traffic dataset, is employed to detect rule violations. The model works in two stages:

Region Proposal Network (RPN): Identifies regions of interest (ROIs) that might contain relevant objects like
vehicles, helmets, and traffic lights.

ObjectClassification& Localization: Assigns class labels to the detected objects and draws bounding boxes to localize them within the image

Number Plate Recognition
After detecting a violation, the system uses Tesseract OCR to extract vehicle registration details from the number plate. The OCR engine is capable of reading characters even when plates are tilted or partially obscured. This step links the detected infraction to a specific vehicle owner.

RESULT AND ANALYSIS:
The developed traffic violation detection system was evaluated through controlled experiments using video footage of real-world traffic scenarios. The assessment focused on both detection accuracy and processing efficiency, particularly for common
violations such as helmetless riding, red-light jumping, and improper lane usage
Faster R-CNN (Accuracy 92.3%)
The system achieved an overall detection accuracy of 92.3%, indicating strong performance in recognizing multiple object classes under varying traffic conditions. The two-stage architecture of Faster R- CNN allowed it to precisely locate and classify objects, even in situations involving partial occlusion or dense vehicular movement.

The integration of Tesseract OCR for license plate recognition resulted in an average recognition accuracy of 87.5%. It could correctly interpret alphanumeric characters even when plates were slightly tilted, shadowed, or partially obstructed

On average, the system was able to detect a violation, extract the number plate, and generate a digital challan within 4 seconds per frame, making it practical for near real- time applications.

The system operated at 710 FPS (frames per second) on standard GPU hardware, which is sufficient for monitoring traffic at moderately busy intersections.

Violation logs, images, and metadata were efficiently stored using MongoDB, enabling fast retrieval and scalable data management.

FUTURE ENHANCEMENTS:

To further advance the functionality and reliability of the proposed system, several enhancements can be explored:

Drone-Based Surveillance
Incorporating aerial monitoring using drones can extend coverage to areas lacking fixed CCTV infrastructure. Drones can provide real-time visuals from elevated perspectives, helping identify violations in remote or congested urban zones where ground cameras may be ineffective.

Integration with Smart City Infrastructure
The system can be connected with existing urban traffic management networks, including adaptive traffic signals, IoT sensors, and centralized control hubs. This would allow real-time coordination based on detected violations, enabling dynamic signal adjustments and faster incident response.

Mobile Application Interface
A user-friendly mobile app can be developed to support both enforcement authorities and the general public. Features such as manual violation reporting, challan tracking, and violation history can promote transparency and encourage community involvement in traffic regulation.

Improved AI Models
To enhance performance under diverse conditions, newer models such as YOLOv8, Vision Transformers (ViTs), or hybrid architectures can be integrated. These models offer faster processing, better object localization, and higher accuracy under varied lighting and environmental settings

Expanded Dataset and Continuous Learning
The systems robustness can be improved by training on a broader dataset that includes different vehicle types, weather conditions, and road layouts. Implementing continuous learning pipelines can also help the model adapt to evolving
traffic patterns and new types of violations.
These enhancements aim to elevate the system from a prototype to a fully deployable, city-wide traffic enforcement platform capable of scaling with future urban mobility challenges.

CONCLUSION
The proposed system presents a practical and scalable approach to addressing traffic violations through automation. By combining the detection capabilities of Faster R-CNN with the recognition power of Tesseract OCR, the model efficiently identifies rule-breaking behaviors and links them to specific vehicles in real-time. Its high accuracy in various traffic conditions and low response time make it suitable for integration into modern traffic surveillance infrastructure.
The system reduces the dependency on manual enforcement, thereby improving consistency, reducing human error, and enhancing road safety. The use of a centralized database further ensures that violation records are stored systematically and can be accessed when needed. Overall, this solution illustrates the potential of AI- driven frameworks to transform traditional traffic management into a more intelligent and autonomous process.
